It's very curious. However, I don't think it's that viable, at least, where I'm from. Would Nuro go through the usual roads to reach its destination? We got Uber Eats somewhat recently, in my zone. Since it's not really a city, the food usually comes from the nearest one, and it's still a bit of a ride. So, a robot doing a 15 minute ride in the middle of other cars, speeding, and whatnot, doesn't seem great. Plus, unattended food going around is kind of a recipe for disaster. Nevertheless, it violates the agreements between the customer and the delivery company, and even the restaurant. It can cause a loss of trust, especially when the issue is food tampering and food safety. This is to say, I agree that work conditions should be improved, and there should be more robust protection and insurances for delivery professionals, but "food ethics" shouldn't be at stake. So, I wanted to see if I could get myself free delivery again. But this time I wasn’t going to take it for granted, I was going to earn it. And it was more than just the lack of mayonnaise with my French fries. In this post I will try to take you on a journey that is larger than this industry. It is a more exciting journey which is about us, humans — and also accidentally the targets of the abundant tech apps. To get my point across I’ve made this post very specific to two cases that many of us know — UberEats and Postmates. For the Doordashes, Deliveroos and Caviars of this world: it could equally have been you. Spoiler alert: if you are too lazy (like me) skip to the conclusion at the bottom. We live in a world of instant gratification Open the app, select, confirm, wait. Knock knock, food is here. Not like current static in-app promotions which last for days, but instead changing deals by the minute which are based on who is around you at that moment and on what they ordered. Concept Description Group orders can be initiated by any customer (“ ”) initiator To post a group order on the food delivery app, the initiator selects a meal from a restaurant and sets a timeframe by which the order is to be placed (“ ”) validity period During the validity period, other customers in the nearby location (“ ”) can join the group order before it expires. The larger the number of neighbors joining, the larger the discount for all customers of that group neighbors If no neighbor joins the group order before expiry, no discount is applied to the order, which is then treated as a normal order One driver picks up all orders (part of the same group order) from the restaurant and delivers them to the neighbors — who are all located in the same/nearby locations Transportation logistics through matching algorithms between drivers, restaurants and customers is already done at UberEats and Postmates. This concept further optimizes operations and will lead to a stronger community. For those who know Nir Eyal’s “Hook canvas”, steps (1) and (3) above would be the “investment”. It is the sum of 2 components: Restaurant Discount (“Rest.Disct”): The restaurant discount thresholds are pre-agreed with restaurants and are a function of the number of neighbors per group order and/or (e.g. “5% for 3 neighbors ordering any meal from restaurant X, 10% for 4 neighbors ordering the Hawaiian Poke Bowl from restaurant X”) for that restaurant for a specific meal : ↗ revenues, ↗ staff utilization and ↗ economies of scale (many orders of same meal) Rationale Delivery Discount (“Deliv.Disct”): The delivery discount thresholds are a function of the number of neighbors per group order (i.e. reduction of delivery cost) and are depending on the financial metric to prioritize: e.g. profit (min. Deliv.Disct, only Rest.Disct), revenue (max. Deliv.Disct and of Rest.Dict to attract volume) : ↗ revenues, ↘ costs (↘ avg. #drivers / order), solves issue of peak time (efficient deliveries) Rationale → Upon creation of a group order by the initiator, an estimate of the discount (Rest.Disct + Deliv.Disct) per potential additional neighbor is indicated. Joining neighbors can also see these estimates. →The final applicable discount is calculated once the group order is placed (end of validity period). All neighbors of that group order benefit from the same final discount. Why is there an expiry to each group order? The intention is to have these group orders especially activated during peak times. A customer placing an order will probably be happy to wait an extra 10–30 minutes if this provides a 5–20% discount in peak times. The extra 10–30 minutes is the time necessary (i) for the group order to reach the end of its validity period and (ii) to deliver the meals to the neighbors ahead in the queue (e.g. first come first served). An initiator could for instance be rewarded by being delivered first. We, humans, love offers which expire, it makes us feel like we live in the moment. Having a validity period has 2 benefits: (i) Limited waiting time, and (ii) Create a sense of urgency. What makes this possible? Customers’ yearly income Over 40–45% of UberEats and Postmates customers’ annual income is lower than 50 k$. In addition, 20–30% customers earn up to 100 k$ per year. It is fair to assume most customers are price sensitive hence group orders will appeal to them because it allows them to eat for a lower price. Customers’ area Most users order from urban areas where density is high, making group orders between strangers feasible. Additional information on customers’ density (e.g. number of customers located within 200 meters radius) would need to be further obtained to confirm this fully. Finickiness and its link to the customers’ age Assumption: age is somewhat correlated to a customer’s finickiness (picky about food choice): Younger users (40–50% of customer base) are typically more willing to compromise and will more easily join group orders even if it does not provide them with their preferred meal choice / restaurant choice Mid-age customers (40–45% of customers base) are expected to be more selective but still willing to compromise every now and then Even if most customers are not expected to be finicky, UberEats and Postmates will collect data to better understand their preferences. Once a group order matches a customer’s preferences, a notification will be sent as invitation to join the order. The low average time spent ordering on the apps indicates that customers are focused on satisfying their appetite rather than eating out of pleasure. Group orders will make it even easier to quickly order. Since I have no access to UberEats’ or Postmates’ data (nor to Storm, Spark or even simply enjoying SQL queries) I had to rely on SurveyMonkey Intelligence. The data above is specific to the USA. Hence the displayed charts might not fully reflect the reality. Tech infrastructure Uber’s Marketplace and Postmates solution already funnel the real-world, real-time requests and locations into their tech infrastructure. Their systems already handle pings from customers, restaurants and drivers in real-time to match them. Only an extra “matching” mechanism between customers (neighbors) is needed for group orders to become reality. UberEats’ and Postmates’ challenges UberEats and Postmates have been able to rely on external funding to subsidize their unit economics. They now need to achieve an unmatched customer experience to be the #1 choice. ’ competitive landscape of the food delivery industry CB Insights For UberEats and Postmates to be considered as food delivery service, they have no other choice than to address every customer’s need at any given time. Our social norms compel us to eat three times a day at predetermined times. This creates delivery challenges in peak times the Transposition of surge pricing from Uber to UberEats is suboptimal due to higher amount of available options to customers (home cooking, delivery from supermarket, physical purchase from supermarket, in-restaurant eating, non-UberEats food delivery) and higher flexibility in timing. In addition it goes against Uber’s pricing model to not charge any fee to the customer (instead it takes 25–30% cut from restaurants compared to 12–23% charged by rivals) The above chart is based on my own assumptions. Constraints Delivery constraints: Since every driver can only transport a limited number of meals, the number of meals per group order should be limited by the space available in the car/motorbike Calculation of the total discount should take this into account: e.g. for a very large order (great for restaurant, too large for one driver): high Restaurant Discount, low Delivery Discount Density and Timing: Density needs to be high enough in order to make it work, i.e. that the meal is delivered to each neighbor within a limited time frame Each displayed group order needs to satisfy two criteria: (i) the restaurant delivers to the customer’s location, and (ii) the customer is located in the vicinity of the initiator. “Vicinity” is to be determined by UberEats / Postmates based on their delivery metrics: is it the same building, within 3 blocks, dependent on traffic, etc Conclusion By now I might have lost you in an excessive level of details, only managing to trigger a desire to grab that big fat snack from your office’s fridge. So let me recap this in a more general manner. In a very saturated market where little differentiation can be achieved on the core offering of a product, it is essential that companies understand how fungible and non-core this very offering actually is. The focus instead should be back on the fundamentals. On fostering a sense of belonging to a community and on rewarding the community members for joining it. The ephemeral character of the community does not matter — it can come and go opportunistically. As long as its members are continuously and variably rewarded. As a condition of his employment, Adolph was required to accept the technology services agreement, and because he did not timely opt out, he became bound by the arbitration provision in that agreement. The arbitration provision requires Adolph to arbitrate, on an individual basis only, almost all work-related claims he might have against Uber. With regard to PAGA actions, the agreement says: “To the extent permitted by law, you and Company agree not to bring a representative action on behalf of others under the [PAGA] in any court or in arbitration. This waiver shall be referred to as the ‘PAGA Waiver.’ ” The agreement also includes a severability clause: “If the PAGA Waiver is found to be unenforceable or unlawful for any reason, (1) the unenforceable provision shall be severed from this Arbitration Provision; (2) severance of the unenforceable provision shall have no impact whatsoever on the Arbitration Provision or the Parties’ attempts to arbitrate any remaining claims on an individual basis pursuant to the Arbitration Provision; and (3) any representative actions brought under the PAGA must be litigated in a civil court of competent jurisdiction . . . .” In October 2019, Adolph sued Uber in superior court, alleging individual and class claims for relief under Labor Code section 2802 and the Unfair Competition Law (UCL) (Bus. & Prof. Code, § 17200 et seq.). As part of our investigation into internet service providers, we collected and analyzed more than  one million internet plans offered across 38 major cities and found that lower-income, least-White, and historically redlined areas were disproportionately offered slow internet speeds for the same price as faster speeds elsewhere in the same city. In the process, we discovered the difficulty of a seemingly simple task of building a representative sample of random addresses in a city. The first issue was finding a data source. Publicly available street address databases were scarce, and those that we could access were incomplete. Even though “clicking around Google Maps” was the accessible, readily available option for most people trying to gather addresses in a given area at any sort of scale, statisticians advised us (and we agree) that it’s biased and shouldn’t be used. We decided to use , which is an open-source repository of addresses and associated geographic coordinates collected from public data from state and local governments. Although OpenAddresses does not include full coverage of the United States, it was the best source we could find and had adequate coverage in the major cities in our investigation. OpenAddresses Coverage aside, we found that many addresses were incomplete—lacking cities, zip codes, and other geographic markers we would need for our analysis. To standardize and complete these addresses, we used the U.S. Census Bureau’s , which lets us map the Census block group and designated place (city) to the geographic coordinates that were provided for every address in the dataset. USPS uses addresses from public data from the open-source project OpenAddresses, and shapes and geographic metadata from the U.S. Census Bureau’s from 2022. Tiger Shapefiles OpenAddresses data was ingested for every address in the United States between Feb. 19 and Feb. 23. In total, the first iteration of USPS contains more than 200 million addresses. The tool is powered by , an extension to the PostgreSQL database that supports geographic objects and spatial queries. PostGIS Rather than make a request to the Census geocoder API for each U.S. address from OpenAddresses, we preprocessed addresses with PostGIS’ . Real-time processing Real-time data processing is a critical requirement for any modern application. Milliseconds count when users are looking for the best experience. AI/ML applications often need to analyze and respond to data as it arrives, whether it's for real-time recommendations, predictive analytics or dynamic pricing models. Cassandra, with its high write and read throughput, is well-suited for such real-time processing requirements. They also have robust data to target users based on a variety of factors - like loyalty to a restaurant, cuisine interest, past items purchased, locations visited, location trends, and more. 137M monthly users Among the ad surfaces, there is a clear duality. Cassandra is used as a feature store by large companies, including and Netflix; under real-world conditions, it can serve features for real-time inference with a tp99 < 23ms. Uber The guide is divided into several key sections. We start by introducing Cassandra and its features that make it an ideal choice for a feature store. Then, we explain the basics of feature stores, including what they are and how they can be used in real-time applications. After that, we explore the implementation details of creating a feature store using Cassandra. This includes data modeling, ingestion and retrieval of features, and handling data updates. Real-time AI . Traditionally, training models and inferences (predictions) based on models have been done in batch – typically overnight or periodically through the day. Today, modern machine learning systems perform inferences of the most recent data in order to provide the most accurate prediction possible. A small set of companies like TikTok and Google has pushed the real-time paradigm further by including on-the-fly training of models as new data comes in. makes inferences or training models based on recent events Because of these changes in inference and changes that will likely happen to model training, the persistence of feature data – data that is used to train and perform inferences for a ML model – needs to also adapt. Typical models involve ~200 features spread across ~10 entities. Real-time inferences require for collecting features, lightweight data transformations, and performing an inference. According to the (also confirmed by our conversations with practitioners), feature stores need to return the features to an application performing inference in under 50ms. time to be budgeted following survey Typically, models require “inner joins” across multiple logical entities – combining rows values from multiple tables that share a common value; this presents a significant challenge to low-latency feature serving. Take the case of Uber Eats, which predicts the time to deliver a meal. Data needs to be joined from order information, which is joined with restaurant information, which is further joined by traffic information in the region of the restaurant. In this case, two inner joins are necessary (see the illustration below). To achieve an inner join in Cassandra, one can either denormalize the data upon insertion or make two sequential queries to Cassandra + perform the join on the client side. Although it’s possible to perform all inner joins upon inserting data into the database through denormalization, having a 1:1 ratio between model and table is impractical because it means maintaining an inordinate number of denormalized tables. Best practices suggest that the feature store needs to allow for 1-2 sequential queries for inner joins, combined with denormalization. A common architecture suggests writing features to an offline store (e.g., Hive / S3) and replication of the features to an online store (e.g., in-memory cache). Even though this provides durability and low latency for feature serving, it comes at the cost of introducing latency for feature writes, which invariably causes poorer prediction performance. Cassandra provides a good trade-off between low-latency feature serving and low-latency “durable” feature writes. Data written to Cassandra has typically been replicated a minimum of three times, and it supports multi-region replication. The latency from writing to availability to read is typically sub-millisecond. As a result, by persisting features directly to the online store (Cassandra) and bypassing the offline store, the application has faster access to recent data to make more accurate predictions. At the same time, CDC, from the online store to the offline store, allows for batch training or data exploration with existing tools. Implement low latency and writes for prediction caching and performance monitoring In addition to storing feature transformation, there is also the need to store predictions and other tracking data for performance monitoring. With a large spike in write workloads, Cassandra automatically prioritizes maintaining low-latency queries and writing TPS over data consistency, which is typically acceptable for performing real-time inference. Implement low-latency, multi-region support As real-time AI becomes ubiquitous across all apps, it’s important to make sure that feature data is available as close as possible to where inference occurs. This means having the feature store in the same region as the application doing inference. Replicating the data in the feature store across regions helps ensure that feature. Furthermore, replicating just the features rather than the raw data used to generate the features significantly cuts down on cloud egress fees. Astra DB supports multi-region replication out of the box, with a replication latency in milliseconds. Our recommendation is to stream all the raw event data to a single region, perform the feature generation, and store and replicate the features to all other regions. Although theoretically, one can achieve some latency advantage by generating features in each region, event data often needs to be joined with raw event data from other regions;. from a correctness and efficiency standpoint, it is easier to ship all events to one region for processing for most use-cases. On the other hand, if the model usage makes the most sense in a regional context, and most events are associated with region-specific entities, then it makes sense to treat features as region specific. Any events that do need to be replicated across regions can be placed in keyspaces with global replication strategies, but ideally, this should be a small subset of events. At a certain point, replicating event tables globally will be less efficient than simply shipping all events to a single region for feature computations. Plan for cost-effective and low-latency multi-cloud support Multi-cloud support increases the resilience of applications and allows customers to negotiate lower prices. Single-cloud online stores such as DynamoDB result in both increased latency for retrieving features and significant data egress costs but also creates lock-in to a single cloud vendor. To minimize the cost of egress, events and feature generation should be consolidated into one cloud, and feature data should be replicated to open-source databases across the other clouds. This minimizes egress costs. Plan for both batch and real-time training of production models Batch processing infrastructure for building models is used for two use cases: building and testing new models, and building models for production. Therefore it was typically sufficient for feature data to be stored in slower object stores for the purpose of training. Support for Lambda architecture Most companies have a Lambda architecture, with a batch layer pipeline that’s separate from the real-time pipeline.
