When talking about data processing, people often abbreviate it as “ETL.” However, if we look closely, data processing has undergone several iterations from ETL, ELT, XX ETL (such as Reverse ETL, Zero-ETL) to the currently popular EtLT architecture. While the Hadoop era mainly relied on ELT (Extract, Load, Transform) methods, the rise of real-time data warehouses and data lakes has rendered ELT obsolete. EtLT has emerged as the standard architecture for real-time data loading into data lakes and real-time data warehouses. Let’s explore the reasons behind the emergence of these architectures, their strengths and weaknesses, and why EtLT is gradually replacing ETL and ELT as the global mainstream data processing architecture, along with practical open-source methods. ETL Era (1990–2015) In the early days of data warehousing, Bill Inmmon, the proponent of data warehousing, defined it as a data storage architecture for partitioned subjects, where data was categorized and cleaned during storage. During this period, most data sources were structured databases (e.g., MySQL, Oracle, SQLServer, ERP, CRM), and data warehouses predominantly relied on OLTP databases (e.g., DB2, Oracle) for querying and historical storage. Handling complex ETL processes with such databases proved to be challenging. To address this, a plethora of ETL software emerged, such as Informatica, Talend, and Kettle, which greatly facilitated integrating complex data sources and offloading data warehouse workloads. Advantages: Clear technical architecture, smooth integration of complex data sources, and about 50% of the data warehouse work handled by ETL software. Disadvantages: All processing is done by data engineers, leading to longer fulfillment of business requirements; high hardware costs with double investments, especially when dealing with large data volumes. During the early and mid stages of data warehousing, when data source complexity was significantly higher, the ETL architecture became the industry standard and remained popular for over two decades. ELT Era (2005–2020) As data volumes grew, both data warehouse and ETL hardware costs escalated. New MPP (Massively Parallel Processing) and distributed technologies emerged, leading to the gradual shift from ETL to ELT architecture in the later stages of data warehousing and the rise of big data. Teradata, one of the major data warehouse vendors, and Hadoop Hive, a popular Hadoop-based data warehousing solution, adopted ELT architecture. They focused on direct loading (without complex transformation like join and group) of data into the data warehouse’s data staging layer, followed by further processing using SQL or H-SQL from the staging layer to the data atomic layer and finally to the summary layer and indicator layer. While Teradata targeted structured data and Hadoop targeted unstructured data, they adopted similar 3–4 layer data storage architectures and methodologies for data warehousing globally. Advantages: Utilizing data warehouse high-performance computing for large data volume processing, resulting in higher hardware ROI. Complex business logic can be handled by SQL, reducing the overall cost of data processing personnel by employing data analysts and business-savvy technical personnel, without the need to understand ETL tools like Spark and MapReduce. Disadvantages: Suitable for simple and large data volume scenarios. Inadequate for complex data sources and lacking support for real-time data warehousing requirements. ODS (Operational Data Store) was introduced as a transitional solution to handle complex data sources that ELT-based data warehouses couldn’t load and to improve real-time capabilities. ODS involved processing complex data sources through real-time CDC (Change Data Capture), real-time APIs, or short-batch processing (Micro-Batch) into a separate storage layer before ELT-ing them into the enterprise data warehouse. Currently, many enterprises still adopt this approach. Some companies place the Operational Data Store (ODS) within the data warehouse and use Spark and MapReduce for initial ETL (Extract, Transform, Load) processes. Later, they perform business data processing within the data warehouse (using tools like Hive, Teradata, Oracle, and DB2). At this stage, the early EtLT (Extract, Transform, Load, and Transform) community has already formed. It is characterized by a division of roles, where the complex processes of data extraction, Change Data Capture (CDC), data structuring, and standardization are often handled by data engineers, referred to as “t.” Their objective is to move data from the source system to the underlying data preparation layer or data atomic layer within the data warehouse. However, traditional CDC ETL tools or real-time stream processing platforms face challenges in providing adequate support for data lakes and real-time data warehouses, either due to compatibility issues with new storage engines or limitations in connecting to modern data sources, lacking robust architecture and tool support. The Emergence of a New Generation of Big Data Federation In modern data architecture, a new breed of architectures has emerged, aiming to minimize data movement across different data stores and enabling complex queries directly through connectors or rapid data loading. These tools excel at data caching and on-the-fly cross-data-source queries, making them unsuitable for support by traditional ETL/ELT tools in this new Big Data Federation paradigm. How We Tried To Fight  Ecommerce Fraud at JunctionX Singapore Hackathon

Background As a junior data scientist, most of the times training data are ready for me to train the model (either by accessing database/external csv file provided). However, dataset is not always available for us, we need scraping skill to make our life easier. One Day Challenge My friend and I decided to start this mini-project which contains the whole process from scraping, to exploratory and finally perform some simple prediction using various machine learning models within 1 day as a small challenge for our own. We notice that a lot of them are like earbuds, headphones, and speaker. 100 63 of them can be found audio devices 2. The largest contribution across different e-commerce platform is the top searched platform from iprice on electronics products ( ), followed by ( ) and ( ). Lazada 82% Qoo10 10% Shopee 6.2% 3. Most frequent products that can be found on Iprice Refer to the following worldcloud, we can see that a lot of can be found on Iprice. It might be due to the fact that Apple products is very common in Singapore. Apple products Performance of Iprice search engine Now, let us filter out the false results returned by Iprice, for example, searching “Apple Ipad Pro” will results in the case for Apple Ipad Pro. Let us get rid of those cases, and see a few more insights: The percentage of exact matched results We found that the accuracy of the search results returned by Iprice on first page is only — out of 1193 search results, only 432 are exactly the item that we are interested in!(WHAT?). However, since we manually label the data to determine whether one result is correct, our labels might contain human errors. 36.21% source 2. The platform that provides most of the CHEAPEST electronic gadgets Last but not least, which platform always sell the cheapest electronic gadget? This is in fact our main target of this project. haha! The answer is => Lazada! After filtered out the false searched results, we grouped all the data by (the original product name from bestproducts.com), and then count the frequency of each platform that provide the lowest price for each product. As shown below: refer_name There are 31 out of 50 products ( ) which can be found in the lowest price on Lazada! 62% Conclusion As a conclusion, it seems like Lazada is the best choice if you want to buy electronic gadget, in the sense that you have the higher chance to get the cheapest price compared to other platform in Singapore. However, as we realised, from the top 100 products we scrapped from bestproducts.com, most of them are , plus the fact that most of Apple products are search-able on iprice. Apple products Besides, there are 37 which we can’t find on iprice. There might be due to two reasons. refer_name Iprice search engine is not good enough. “Anyone who isn’t embarrassed of who they were last year probably isn’t learning enough.” — Alain de Botton If someone randomly asked you: , you can probably come up with tons of answers. And that’s normal — all of us have an innate desire for new knowledge and skills. “What are some things you want to learn?” But for many of us, our goal to learn new skills just stay as goals, and don’t become a reality. Or, we only pick up these skills when we’re forced to do so, like when we sign up for a class, or are thrown into a new project or job. But we can’t always rely on being forced to learn. What we have to do is to be more purposeful & strategic about how we learn new concepts and skills. Constant Learning — The #1 Life Hack If you take a look at some of the most successful people in the world, they all made it there not by sheer talent or luck, but by . constant growth and learning They took the time to think about what they want to learn, how to learn it best, and how to schedule the time for it. Then, they doubled down in applying those learnings to create successful outcomes for them. In this article, I’ll be outlining my framework on how I created a system for constant learning for myself. I’m writing this mainly for other students, who want to learn more about how best to learn the concepts/skills they want to learn. Over the past 3 years, I’ve been able to make time to learn about concepts I’m really interested in, from to . I’ve also been able to learn a number of different skills for my career, such as . growth hacking Bitcoin and blockchain UI/UX Design and Front-End Web Development These are things I thought I wouldn’t be able to learn when I was younger, but by using the right strategies and resources, I was able to. Now I’d like to share some of the steps you can take to learn new things constantly too. #1: Make a short list of concepts/skills you want to learn more about, and rank them by priority “Working on the right thing is probably more important than working hard.” - Caterina Fake, co-founder of Flickr The most important step in creating a great environment for learning is knowing what to learn first. So you should make a quick list of concepts you want to learn, and skills you want to pick up, for the next few months. Some possible concepts you can put are Bitcoin/cryptocurrencies, health & fitness, or mental health. Meanwhile, some possible skills are learning to code, how to get better at design, or learning a new language. Prioritize Them Properly After writing or typing down your list, what you’d want to do is to rank and prioritize them. You want to rank them based on criteria important to yourself. Some criteria could include: “Will this help me in my career?”, “How passionate am I about this?”, or “How hard is it to learn?” You can even do this on a spreadsheet, and put a score over 10 for each criteria, for each concept or skill. Or, you can just rank them by yourself intuitively. These are just suggestions to help you decide. Ideally, you should be able to strike out concepts or skills in your list that aren’t that important to your career, that you aren’t as passionate about, or that are too difficult to learn in the timeframe. You’d want to keep your list of things you’re learning limited to 1–3 things at a time, because that’s how you’ll keep yourself focused. Also, you’d want to make your list of things to learn to be more specific, so you’ll be more focused when you go about learning them. #2: Figure out how you learn best The next step is to figure out what your learning style is, because that will determine how you can learn the most and the fastest. There are many different ways to categorize learning styles, but a popular one is the VARK model, theorized by Neil Fleming. Fleming says that there are 4 main learning styles — Visual, Auditory, Read/Write, and Kinesthetic. If you’re the type who loves watching videos to learn, then you’re a visual learner. Visual learners prefer images and graphics more. Meanwhile, or hear someone speak about it. If you’re an auditory learner, finding a teacher or a podcast is the best way to go. auditory learners learn best when they hear it, If you love reading books, then you’re likely in this category. Lastly, Read/Write learners prefer learning through reading words. kinesthetic learners prefer experiencing and practicing something to learn about it. Of course, in reality, most of you will fall into more than one category. And, you’re likely to use more than one category to learn a skill or topic. For me, I used to be a very visual learner — meaning I needed to watch videos, like online courses, to learn new concepts or skills. However, I’ve since learned to use podcasts/audiobooks and books/articles to learn as well. So give some thought about how you think you’ll learn the best. For most people, videos will be the most effective, but podcasts/audiobooks and books/articles are also quite effective for learning. #3: Find out what the best resources are for you “An expert is a man who has made all the mistakes which can be made, in a narrow field.” — Niels Bohr Once you’ve figured out what to learn and how you learn, it’s time to look for resources. The main thing people usually do is to use Google. You can Google things like “Best UI/UX Design Books”, or “Best Javascript Courses”. However, Google isn’t always the best tool for this. A better strategy is to find someone, hopefully within your network, or a respected writer online, who has learned that specific skill or concept you’re trying to learn. Then, you can ask that person to recommend to you some paid or free resources he/she used and loved. Also, instead of reading a generic list of courses online, you can find articles by an author online, who can recommend 1 or 2 courses that he/she loved. Of course, it’s best to find a resource that multiple people say is great. What works for one might not work for you, and there might be a better resource already. The point is to keep looking until you’ve found an article, book, video, or podcast that looks reputable, interesting, and informative. #4: Schedule in the time to learn One of the most important steps is to also schedule in the time to learn. Whether you’re a student or already working, you’re likely to already have a busy schedule. And that’s why it’s easy to slip up and not have the time to learn. But whether it’s 20 minutes or 1 hour a day, all of us can devote a small portion of our time to learning. You can cut back on other non-valuable activities, like scrolling on Facebook or Instagram, to make time for learning. For me, I make sure to listen to a podcast when I eat breakfast, or read a book on my phone or laptop while waiting before a class. I make sure to spend most of my free time learning, and I’m sure you can too. #5: Have one or more learning partners. Or better yet, find someone to mentor you. “If you want to lift yourself up, lift up someone else.” — Booker T. Washington When you find yourself immersed in a new skill or concept, it’s best to be learning it with someone else too. That way, you can keep each other accountable. You can share to each other anything you find unclear, or just have someone to motivate you. What’s even better is if you can find someone to check up on your progress, and give you advice. When I was learning about UI/UX design, I was lucky enough to have a mentor — my friend . If you’re wondering how to find a mentor for yourself, you can read , written by Alexis himself. Alexis this article While I was working on a website design project, Alexis would look over some of my designs, point out where I was lacking in, and give me advice on how to improve. Having that fast feedback loop allowed me to improve really fast, and I encourage you to find a team or person that can mentor you or learn alongside you. #6: Redesign your social media feeds to let you learn new things too. Of course, even if I’m very focused on productivity, I can’t help but use social media too. It’s how I keep updated about my friends, local news, and school-related updates. However, I’ve also made sure to redesign my social media feeds in a way that value-adding content pops up. I made sure to like the pages of publications, like TechCrunch, which writes about tech news and updates. I make sure to read or bookmark any design or career-related articles on Facebook, especially those shared by my friend Alexis. I subscribe to YouTube Channels like and , both of which make really great, informative videos. The Verge Vox #7: Share your learnings with friends. Or better yet, write an article or give a talk about it. “The person who says he knows what he thinks but cannot express it usually does not know what he thinks.” — Mortimer Adler Lastly, one of the best ways to fully learn a concept or master a skill is to teach that skill to others. This is a method popularly called , named after Richard Feynman, a Nobel Prize winning physicist. The Feynman Technique The Feynman Technique basically is about doing 4 steps. The first is to pick a concept you’ve recently learned. Next, you should write or say an explanation of the concept, but you need to notice where you struggle to explain the concept. After this, the third step is to look up resources that can help you explain the concept better. Then, after researching, the last step is to change your explanation to make it simpler and clearer. You can repeat steps 2–4 until it’s simple enough for your audience. Master a Concept by Teaching It I’ve noticed how in my own life, it’s the talks or workshops that I’ve been invited to give, or the concepts I’ve needed to explain to others, that I’ve mastered the most. For example, I had to learn the concept of journey mapping as part of my internship at last summer, because we had to make a journey map for the company. I researched as much as I could about the concept, and I proceeded to make notes, and then make the journey map. Shopee A few days later, my friend Pierce happened to message me, asking if I would be willing to give a workshop — on . What a coincidence. Journey Mapping I saw the workshop as an opportunity to master the concept more, so I accepted it. I prepared as much as I can, writing out what I’d say, and seeing where I needed to explain things more. Now, after having given a workshop about it, I’m a lot more confident about the topic. Step #8: Rinse and Repeat. Once you’ve learned what you set out to learn, and once you feel you’ve mastered the skill or concept enough, such as by teaching it or writing about it, then it’s time to move on. Revisit your list of things to learn by doing step 1 again, and move on to the next items to learn. Or, look for things to add. Have fun with it! There’s No Excuse for Not Learning Regularly All in all, there really is no excuse for not learning regularly. There are a myriad of ways you can learn new skills and concepts, and you can spend as little as 20 minutes a day to doing so. If you’re the type who needs to be forced to learn something, then I suggest you choose a class or course, online or offline, that forces you to learn your desired skills/concepts. Or, you can take an internship or do freelance work that lets you learn and improve in that skill better. If you’re the type who is too busy with work or school, there is still no excuse. The time you spend eating or commuting can still be spent listening to a podcast or watching an informative video. If you need to destress, there are tons of videos that are both funny and informative. I love the exactly for this reason. Silicon Valley TV show So there really is no excuse. Of course, if you’re not used to spending this much time for learning, you can take one or two days off to recover. But after a while, you’ll get used to constantly learning, and you’ll see how it can be so satisfying to learn. So go out there, use the steps in this article, and be more strategic about learning. Amazon’s monopolistic conduct also harms consumers in both markets, shoppers and sellers alike, by depriving them of the benefits of open, fair competition and allowing Amazon to exploit its monopoly power without facing the competitive checks of a free enterprise system. 434. The presence of scale economies and network effects in both relevant markets means that a firm must be able to gain scale in order to compete effectively. But Amazon has artificially suppressed rivals’ ability to attract business, gain momentum, and grow. 435. Amazon’s conduct interrupts, impedes, and distorts the normal give-and-take of a healthy market by blocking off every major avenue of competition—including price, product selection, quality, and innovation—that rivals and potential rivals would ordinarily use to compete on the merits for shoppers’ and sellers’ business in the relevant markets for online superstores and online marketplace services. 436. For example, Amazon’s anti-discounting conduct leverages both its first-party Retail and its third-party Marketplace business units to suppress competition. Amazon’s firstparty anti-discounting algorithm disciplines rivals from undercutting Amazon’s prices, and Amazon punishes third-party sellers for offering lower prices on other platforms. Without the ability to attract either shoppers or sellers through lower prices, rivals are unable to gain a critical mass of customers and meaningfully compete against Amazon. At the same time, Amazon’s coercive fulfillment conduct both artificially stunts the growth of independent fulfillment providers and artificially raises the costs that sellers face when seeking to multihome. This limits seller multihoming and thereby suppresses Amazon’s rivals’ ability to compete for sellers by offering better terms and for shoppers by offering additional product selection. 437. Together, Amazon’s exclusionary course of conduct works to suppress competition in both relevant markets, foreclosing even an innovative, high-quality rival or potential rival from competing on the merits. 438. Amazon’s conduct also harms consumers in both relevant markets. For example, Amazon’s conduct has artificially inflated prices for both shoppers and sellers, degraded the quality of online superstores for shoppers and of online marketplace services for sellers, reduced output in both relevant markets, hindered shoppers from comparison-shopping for the best deals, suppressed the flow of useful price and quality information to shoppers, stifled sellers’ ability to gain additional business by offering lower prices, restricted sellers’ freedom to choose to multihome across their preferred sales channels, reduced consumer choice for both shoppers and sellers by yielding a less diverse set of competitive options, and stripped consumers in both relevant markets of the benefits of innovation. 439. Amazon’s anticompetitive conduct is not reasonably necessary to achieve any cognizable procompetitive benefits. The anticompetitive harm from those practices outweighs any procompetitive benefits, and Amazon could reasonably achieve any procompetitive goals through less restrictive alternatives. 440. Amazon’s unlawful conduct has caused cumulative and compounding harm over time. Through its years-long course of illegal conduct, Amazon has deeply entrenched its monopolies in both relevant markets and further widened the gulf between Amazon and everyone else. Particularly given the importance of scale economies and network effects in these markets, Amazon’s conduct has yielded a distorted and stunted competitive landscape. 441.
